In our previous work¹ , we presented a block-based technique to analyze printed page uniformity both visually and metrically. The features learned from the models were then employed in a Support Vector Machine (SVM) framework to classify the pages into one of the two categories of acceptable and unacceptable quality. In this paper, we introduce a set of tools for machine learning in the assessment of printed page uniformity. This work is primarily targeted to the printing industry, specifically the ubiquitous laser, electrophotographic printer. We use features that are well-correlated with the rankings of expert observers to develop a novel machine learning framework that allows one to achieve the minimum "false alarm" rate, subject to a chosen "miss" rate. Surprisingly, most of the research that has been conducted on machine learning does not consider this framework. During the process of developing a new product, test engineers will print hundreds of test pages, which can be scanned and then analyzed by an autonomous algorithm. Among these pages, most may be of acceptable quality. The objective is to find the ones that are not. These will provide critically important information to systems designers, regarding issues that need to be addressed in improving the printer design. A "miss" is defined to be a page that is not of acceptable quality to an expert observer that the prediction algorithm declares to be a "pass". Misses are a serious problem, since they represent problems that will not be seen by the systems designers. On the other hand, "false alarms" correspond to pages that an expert observer would declare to be of acceptable quality, but which are flagged by the prediction algorithm as "fails". In a typical printer testing and development scenario, such pages would be examined by an expert, and found to be of acceptable quality after all. "False alarm" pages result in extra pages to be examined by expert observers, which increases labor cost. But "false alarms" are not nearly as catastrophic as "misses", which represent potentially serious problems that are never seen by the systems developers. This scenario motivates us to develop a machine learning framework that will achieve the minimum "false alarm" rate subject to a specified "miss" rate. In order to construct such a set of receiver operating characteristic² (ROC) curves, we examine various tools for the prediction, ranging from an exhaustive search over the space of the nonlinear discriminants to a Cost-Sentitive SVM³ framework. We then compare the curves gained from those methods. Our work shows promise for applying a standard framework to obtain a full ROC curve when it comes to tackling other machine learning problems in industry.

Periodic clustered-dot screens are widely used for electrophotographic printers due to their print stability. However, moir´e is a ubiquitous problem that arises in color printing due to the beating together of the clustered-dot, periodic halftone patterns that are used to represent different colorants. This beating or interference phenomenon introduces spurious low frequency (large period) patterns in the printed output that are very objectionable to the viewer. The traditional solution in the graphic arts and printing industry is to rotate identical square screens to angles that are maximally separated from each other. For example, the classic three-color screen set rotates three identical square screens to the angles 15°, 45°, and 75°, respectively. However, the effectiveness of this approach is limited when printing with more than four colorants, i.e. N-color printing, where N >4. Moreover, accurately achieving the angles that have maximum angular separation requires a very high resolution plate writer, as is used in commercial offset printing. In this paper, we propose a systematic way to design color screen sets for periodic, clustered-dot screens that offers more explicit control of the moir´e properties of the resulting screens when used in color printing. We find a general concept for moir´e-free screen design that is called lattice-based screen design. The basic concept behind our approach is the creation of the screen set on a 2-dimensional lattice in the frequency domain and then picking each fundamental frequency vector of the individual colorant planes in the created spectral lattice according to the desired properties. The halftone geometry of a screen set is the set of angles and frequencies in units of lines per inch (LPI) of each screen plane. The lattice-based screen design offers more flexibility in designing N-color screen sets with different halftone geometries, and all of them are guaranteed to be all-orders moir´e-free. For example, by creating a square lattice in the frequency domain, square N-color moir´e-free screen sets that consist of N rotated square screens can be achieved. The proposed approach maintains the advantage of square clustered-dot screen design and is based on low addressability of digital printing. We also propose several symmetry measures, and use them to compare the proposed 4-color square screen set and the screen sets based on a previous moir´e-free N-color non-orthogonal approach. The proposed screen set is shown to have better symmetry properties.

Fine-pitch banding is one of the most unwanted artifacts in laser electrophotographic (EP) printers. It is perceived as a quasiperiodic fluctuation in the process direction. Therefore, it is essential for printer vendors to know how banding is perceived by humans in order to improve print quality. Monochrome banding has been analyzed and assessed by many researchers; but there is no literature that deals with the banding of color laser printers as measured from actual prints. The study of color banding is complicated by the fact that the color banding signal is physically defined in a three-dimensional color space, while banding perception is described in a one-dimensional sense such as more banding or less banding. In addition, the color banding signal arises from the independent contributions of the four primary colorant banding signals. It is not known how these four distinct signals combine to give rise to the perception of color banding. In this paper, we develop a methodology to assess the banding visibility of the primary colorant cyan based on human visual perception. This is our first step toward studying the more general problem of color banding in combinations of two or more colorants. According to our method, we print and scan the cyan test patch, and extract the banding profile as a one dimensional signal so that we can freely adjust the intensity of banding. Thereafter, by exploiting the pulse width modulation capability of the laser printer, the extracted banding profile is used to modulate a pattern consisting of periodic lines oriented in the process direction, to generate extrinsic banding. This avoids the effect of the halftoning algorithm on the banding. Furthermore, to conduct various banding assessments more efficiently, we also develop a softcopy environment that emulates a hardcopy image on a calibrated monitor, which requires highly accurate device calibration throughout the whole system. To achieve the same color appearance as the hardcopy, we perform haploscopic matching experiments that allow each eye to independently adapt to different viewing conditions; and we find an appearance mapping function in the adapted XYZ space. Finally, to validate the accuracy of the softcopy environment, we conduct a banding matching experiment at three different banding levels by the memory matching method, and confirm that our softcopy environment produces the same banding perception as the hardcopy. In addition, we perform two more separate psychophysical experiments to measure the differential threshold of the intrinsic banding in both the hardcopy and softcopy environments, and confirm that the two thresholds are statistically identical. The results show that with our target printer, human subjects can see a just noticeable difference with a 9% reduction in the banding magnitude for the cyan colorant.

Monochrome and color models for the rendering device and human visual system are presented, and model-based, iterative approaches to digital halftoning and application to model-based monochrome and color halftoning are discussed.
